Keep evaluation records out of the learned preparation steps
A clean train/test label cannot repair preparation that already learned from the evaluation rows.

A predictive workflow learns more than the final model coefficients. Data-dependent preparation can absorb information from records meant to test generalization. Review where every learned transformation is fitted and reused, rather than accepting a split diagram that starts after preparation is complete.
What you will leave with: A learned-step lineage map with fit populations, transformation reuse and an analyst-owned evaluation repair decision.
Use this when
- A supplier reports held-out performance after preparing the entire dataset.
- Feature selection, scaling or missing-value treatment occurs before model evaluation.
This is preprocessing-boundary review, not a replacement for prediction-time feature checks, calibration or grouped/time-aware evaluation. Use synthetic lineage examples; no customer export, model deployment or automated decision is authorized.
Inventory what the workflow learns before final fitting
Ask the analyst to list every step between raw permitted records and predictions. Separate fixed rules supplied independently, such as an approved unit conversion, from quantities estimated from the dataset. Record which rows influence each estimated quantity or selected feature. A step labeled cleaning can still learn from the data; its reassuring name does not place it outside the evaluation boundary.
The scikit-learn pitfalls guide says preprocessing transformations must be learned from training data and then applied to evaluation data. It explicitly includes feature selection and other learned transformations among leakage risks. The implication is that evaluation separation belongs around the complete learned workflow, not only around the final estimator.
Trace the fitting population of each learned step
Build a lineage row containing the step, its input version, the population used to estimate it and the records to which it is later applied. Distinguish fitting a transformation from using an already fitted transformation. Ask for implementation evidence that supports those labels. A presentation showing different colored train and test boxes is insufficient if an upstream process used both boxes to choose the representation.
For repeated validation, have the analyst explain how learned preparation is repeated within the relevant training portion rather than reused after learning from the complete collection. Keep the intended group and time separation intact as well. Do not create a more impressive score by moving repeated records between partitions or quietly using later information. This lesson checks the learned-step boundary; the suitability of the partition itself remains a separate analytic judgment.
Use a controlled audit to locate the first contamination
Request a small synthetic demonstration or sanitized execution record showing where the population first changes from training-only to mixed. Inspect intermediate artifacts such as selected column lists or stored transformation parameters without requesting personal rows. Ask which artifacts must be regenerated if that boundary is wrong. Refitting only the final model may leave an earlier contaminated representation untouched.
Keep a suspected leakage finding distinct from an accusation of deception. A reusable preparation script may have been built for production data processing and then reused in an evaluation where its fitting scope is inappropriate. Document the concrete dependency and have the analyst reproduce the corrected procedure. Do not predict how much the score must fall; the defect invalidates the earlier claim of separation, but the size of the effect requires evidence.
Accept the repaired evidence without overstating its reach
Preserve both the original evaluation description and the corrected workflow version. State which learned steps changed, how evaluation records were excluded from fitting and what evidence was reserved for the final assessment. If the evaluation has repeatedly guided model choices, ask the analyst whether additional untouched evidence is needed. Relabeling already inspected rows as final test data does not erase their role in earlier decisions.
Report the revised result with its population, outcome window and remaining limitations. A corrected preprocessing boundary does not resolve biased labels, missing outcomes or a mismatch between the evaluation sample and future use. Keep the audit focused enough that another reviewer can trace each learned artifact to its fitting records. The deliverable is an inspectable separation claim, not a blanket certification that the model is safe or useful in every customer workflow.
Make the reasoning concrete.
A fictional marketing team evaluates a classifier for organizing opted-in workshop enquiries. Its report has separate training and test files, but the preparation notebook chose the final feature set from the complete labeled archive before creating those files.
Accept the split filenames
Opening: Treat separate files as proof that the evaluation was independent.
Hypothesis: The final model did not directly fit on the test file.
Risk: The selected representation already used information from the evaluation records.
Trace the learned preparation
Opening: Have the analyst rebuild feature selection within the training workflow and preserve a valid assessment boundary.
Hypothesis: The reported separation applies to the complete fitted procedure.
Risk: The corrected result may differ and still needs other validity checks.
The team requests the lineage repair and keeps ordinary enquiry handling unchanged. It does not publish a replacement accuracy claim until the corrected evaluation evidence is available.

Steps
Which preparation operations estimate values or select features from records?
Fit scope
Which population influenced each learned artifact?
Reuse
Where is that artifact applied without refitting?
Repair
Which upstream outputs need regeneration after a boundary defect?
Evidence
What evaluation remains appropriate after the model-development choices?
Watch for the wrong conclusion.
- Treating every cleaning operation as independent of model fitting.
- Splitting rows only after learning the feature representation.
- Repairing the final estimator while retaining contaminated preparation artifacts.
Your next action
Choose one reported predictive score and trace the fitting population of the preparation step immediately before the final estimator.
